Two JITs, One Problem: What Building a Tracing JIT Taught Me About CPython’s Copy-and-Patch Compiler

I built a tracing JIT compiler for a small language called Monkey. It records hot loop traces into an SSA-style IR, runs 12 optimization passes, and compiles the result to JavaScript via new Function(). It gets a ~10x average speedup over the bytecode VM on 26 benchmarks, with peaks of 29x on tight numerical loops.

CPython is building something architecturally very different: a copy-and-patch JIT that assembles pre-compiled machine code stencils at runtime, patching in addresses and constants. The initial targets were a 5% geometric mean speedup for Python 3.15 and 10% for 3.16. As of March 2026, the Python 3.15 alpha is already exceeding those targets: 11-12% faster on macOS AArch64 and 5-6% on x86-64 Linux — numbers that represent a huge win at CPython’s scale.

These two JITs solve the same fundamental problem — make dynamic language execution faster — but they make completely different tradeoffs. Having built one, I find the other fascinating. This post is an honest comparison of both approaches, what each does well, and what I’ve learned that might be relevant to CPython’s ongoing JIT work.

The Fundamental Difference: Recording vs. Stitching

A tracing JIT and a copy-and-patch JIT don’t just differ in implementation — they differ in philosophy.

My Monkey JIT: observe, then specialize. The VM interprets bytecode normally, counting loop back-edge executions. After 16 iterations of a hot loop, it switches to recording mode. Every bytecode instruction emits a corresponding IR instruction into a linear trace. The trace recorder follows execution across function call boundaries (up to 3 levels of inlining), turning branches into guards. When the loop completes one iteration, recording stops. The recorded trace is optimized and compiled.

The key insight: a trace is a linear sequence of instructions with no control flow. Branches become guards — assertions that say “this value must be an integer” or “this condition must be true.” If a guard fails at runtime, execution deoptimizes back to the interpreter. This linearity makes optimization almost trivially simple: no dominance frontiers, no phi nodes in the traditional sense, no complex control flow analysis. Just a flat array of instructions you can scan forward and backward.

CPython’s JIT: pre-compile, then assemble. At CPython’s build time, LLVM compiles each micro-operation (uop) into a machine code “stencil” — a relocatable binary fragment with holes for runtime values. At runtime, when code gets hot, CPython selects appropriate stencils, copies them into executable memory, and patches in the specific addresses, constants, and jump targets. No LLVM at runtime. No IR to optimize. The compilation step is essentially memcpy + fixup.

This makes compilation blazingly fast — there’s no optimization pipeline to run at runtime. The cost is paid upfront during the CPython build. End users never need LLVM installed.

What My JIT Does (In Detail)

Monkey is a dynamically-typed language with integers, booleans, strings, arrays, hash maps, closures, and first-class functions. My JIT sits on top of a bytecode compiler and stack VM. Here’s the pipeline:

Trace Recording

When a loop back-edge fires 16 times, the trace recorder activates. It piggybacks on the VM’s main execution loop — for every bytecode instruction the VM executes, the recorder emits a corresponding IR instruction:

The recorder maintains a parallel “virtual stack” of IR references, mirroring the VM’s value stack. Each guard captures a deoptimization snapshot — a mapping of local/global slots to their IR references at that program point — so guard failures can restore exact interpreter state.

The IR

The IR has ~52 opcodes: constants, loads/stores, integer arithmetic on raw JS numbers, comparisons, type guards, box/unbox operations, array indexing with bounds checking, hash lookups, builtin operations, and control flow. Everything is SSA — each instruction produces a value referenced by its index in the flat trace array.

A key property: type guards separate the “check” from the “use.” GUARD_INT asserts a value is a MonkeyInteger, and subsequent UNBOX_INT extracts the raw JS number. This separation is what makes box/unbox elimination work — if you can prove the unbox feeds directly into a box (or vice versa), both are dead.

Optimization: 12 Passes on a Flat Array

Because traces are linear, each pass is a single forward or backward scan over the IR array. No graph algorithms. No fixed-point iteration (except for LICM, which needs a small fixpoint to identify all invariants). The passes, in order:

  1. Store-to-load forwarding — If we store to slot X and later load from slot X with no intervening store, replace the load with the stored value reference. This is the most impactful pass because it breaks the box→store→load→guard→unbox chain across loop iterations.

  2. Box/unbox eliminationUNBOX_INT(BOX_INT(x))x. After store-to-load forwarding creates these patterns, this pass collapses them. This is where the real speedup lives: loop variables that would be boxed and unboxed every iteration now stay as raw JS numbers.

  3. Common subexpression elimination — Same opcode + same operands = same result. Tracks stores that invalidate load CSE entries. Uses a deferred replacement strategy to avoid mutating operands during the scan.

  4. Unbox deduplication — Catches duplicate unboxes that CSE misses due to compaction/reindexing.

  5. Redundant guard elimination — If a value has been guarded as integer, subsequent integer guards on the same reference are dead. Constants never need guards. Values produced by ADD_INT are known integers.

  6. Range check elimination — The most interesting pass. If the loop condition is i < len(arr) and the guard checks 0 <= i < len(arr), the upper bound check is redundant. For the lower bound, I implemented induction variable analysis: if a variable starts non-negative and increments by a positive constant each iteration, it’s provably non-negative. When both bounds are proven, GUARD_BOUNDS is eliminated entirely. This gave a 19% improvement on array-heavy workloads.

  7. Constant propagation — Tracks known values through arithmetic and slot stores/loads.

  8. Constant foldingADD_INT(3, 4)CONST_INT(7).

  10. Dead store elimination — If slot X is written twice with no intervening read, the first write is dead.

  11. Loop-invariant code motion — Moves instructions whose operands are all defined before the loop (or are themselves loop-invariant) above LOOP_START. Guards can be hoisted too — a hoisted guard uses simplified exit codegen (no side-trace dispatch).

  12. Dead code elimination — Walk backward from live roots (stores, guards, control flow), mark reachable instructions, null out the rest.

Code Generation: Loop Variable Promotion

The compiler’s most important optimization isn’t in the IR passes — it’s in codegen. Loop variable promotion identifies globals/locals that are stored as BOX_INT(raw_value) and loaded+unboxed each iteration. These get promoted to raw let variables above the loop:

The inner loop has zero object allocations. V8 sees tight numerical code and JIT-compiles it to efficient machine code. We get a JIT compiling to a JIT — turtles all the way down.

Side Traces and Deoptimization

When a guard fails repeatedly (8 times), a side trace is recorded from the failure point. If the side trace rejoins the parent trace’s loop header, it’s inlined directly into the parent’s compiled code — no function call overhead, no write-back/reload of promoted variables. The parent is recompiled with the side trace body spliced into the guard exit path.

Guard failures that aren’t hot enough for side traces use deoptimization snapshots to restore exact interpreter state. Each guard carries a snapshot mapping slots to their current IR references, so the write-back function can reconstruct the VM’s stack and globals at the exact bytecode position.

How CPython’s Copy-and-Patch JIT Works

CPython’s JIT pipeline has three main components: the specializing adaptive interpreter, the trace frontend, and the copy-and-patch code generator.

The Specializing Adaptive Interpreter

Before the JIT even gets involved, CPython 3.11+’s interpreter is already specializing bytecodes based on observed types. BINARY_OP becomes BINARY_OP_ADD_INT when it sees two integers. These specialized instructions use monomorphic inline caches — they remember one type, and deoptimize on a miss.

This feeds into a lower-level representation: micro-operations (uops). Each specialized bytecode instruction decomposes into a sequence of simpler uops. These uops are what the JIT actually compiles.

Trace Frontend: From Projection to Recording

In Python 3.13/3.14, CPython used trace projection: it guessed where execution would go based on inline cache data and constructed traces speculatively. As Ken Jin documented, this had fundamental limitations — CPython’s monomorphic inline caches meant the projector often worked with stale or contradictory type information.

For Python 3.15, Ken Jin rewrote the entire frontend to use trace recording — a dual-dispatch mechanism where the interpreter switches between its normal dispatch table and a tracing dispatch table. This captures live, up-to-date execution data instead of guessing. The result: 50% more JIT code coverage and support for generators, custom dunders, and object initialization that the projection approach couldn’t handle.

This is exactly the architecture my Monkey JIT uses — and it’s telling that CPython independently arrived here too. Trace recording gives you ground truth about what the program actually does. Projection gives you a guess.

The Copy-and-Patch Code Generator

Here’s where CPython diverges completely from my approach. Instead of building an IR and optimizing it, CPython:

  1. At build time, uses LLVM/Clang to compile each uop into a machine code fragment (stencil). Clang’s musttail attribute ensures continuation-passing-style dispatch between uops. The stencils have “holes” — relocatable addresses for runtime values.

  2. At runtime, copies stencils into executable memory and patches the holes with actual addresses, constants, and jump targets.

The entire runtime code generator is ~100-400 lines of C. The heavy lifting is ~1000 lines of build-time Python that orchestrates LLVM. No runtime LLVM dependency.

This design makes compilation nearly instantaneous — it’s essentially memcpy + pointer arithmetic. But it means optimization opportunities are limited to what LLVM can do to individual stencils at build time, plus whatever the uops optimizer can do at the IR level before stencil selection.

Current Optimizations

The uops optimizer currently performs type propagation (eliminating redundant type checks when types are known), guard elimination, and some constant folding. Brandt Bucher has been working on branch inversion in the generated assembly — rearranging code so the hot path falls through without a jump, which gave a 1% geometric mean improvement. Mark Shannon and Diego Russo are working on better AArch64 codegen.

Register allocation / top-of-stack caching is planned: using Ertl’s 1995 technique to maintain a state machine tracking what’s in registers vs. the stack, reducing memory access overhead. Reference count elimination — removing redundant incref/decref pairs — is another major target.

Honest Comparison: Where Each Approach Shines

Tracing JIT Advantages

Cross-boundary optimization. My JIT follows execution across function calls (up to 3 levels), inlining the callee’s body into the trace. A call to map(fn, array) becomes a tight loop with the mapping function’s body spliced in. Copy-and-patch compiles individual uops — it can benefit from the interpreter’s inlining of calls into traces, but the stencil boundaries limit how much cross-uop optimization the code generator can do.

Global optimization on linear traces. Store-to-load forwarding, box/unbox elimination, range check elimination, LICM — these are cheap on a flat IR array and can dramatically reduce overhead. My range check elimination pass uses induction variable analysis to prove bounds checks are unnecessary, eliminating them entirely. CPython’s optimizer operates on uops before stencil assembly, but the post-assembly code is a chain of pre-compiled fragments with limited cross-fragment optimization.

Aggressive speculation with recovery. Guards encode speculative assumptions and deoptimization snapshots enable safe recovery. The JIT can speculate that a value will always be an integer, operate on raw numbers for the entire loop body, and fall back to the interpreter only if the speculation fails. This is how my JIT eliminates all boxing in tight loops.

Copy-and-Patch Advantages

Compilation speed. My JIT runs 12 optimization passes at runtime. CPython’s copies memory and patches pointers. For a language like Python where compilation speed affects startup time and time-to-first-optimization, this is a massive practical advantage.

Real machine code. My JIT compiles to JavaScript strings and relies on V8/SpiderMonkey to JIT them to machine code. CPython’s stencils are machine code — LLVM-optimized, register-allocated, instruction-scheduled native code. There’s no second JIT in the loop. The generated code quality for individual operations is likely better than what my IR-to-JS-to-V8 pipeline achieves.

Maintainability at scale. CPython has hundreds of contributors and needs to work on x86_64, AArch64, and more. Writing optimization passes that are correct across all platforms is expensive. Copy-and-patch pushes platform-specific concerns to LLVM at build time — the runtime code is platform-agnostic. My JIT’s 2400 lines of optimizer code would be a significant maintenance burden for CPython.

Production constraints. CPython can’t afford the warm-up latency, memory overhead, or stability risk of an aggressive tracing JIT. A 5-10% steady improvement with minimal risk is worth more to Python’s user base than 10x on microbenchmarks with occasional deoptimization storms.

What I Learned That’s Relevant to CPython

1. Store-to-Load Forwarding Is the Killer Optimization

In my JIT, the single most impactful optimization is breaking the box→store→load→guard→unbox chain across loop iterations. A Monkey while loop that increments i by 1 each iteration does this per iteration without the JIT:

  1. Compute i + 1 → raw number
  2. Box into MonkeyInteger
  3. Store to global slot
  4. (Next iteration) Load from global slot
  5. Guard: check it’s a MonkeyInteger
  6. Unbox to raw number

After store-to-load forwarding + box/unbox elimination + loop variable promotion, step 2-6 disappear. The loop variable lives as a raw let variable for the entire loop.

CPython has an analogous problem with reference counting. Every operation increments and decrements reference counts, even for values that are clearly alive. Reference count elimination — the planned optimization of removing redundant incref/decref pairs — is CPython’s version of my box/unbox elimination. It’s eliminating bookkeeping overhead that’s only necessary at boundaries, not within hot loops.

2. Induction Variable Analysis Pays for Itself

My range check elimination pass identifies loop counters — variables that start non-negative and increment by a positive constant — and proves their non-negativity. Combined with the loop condition implying the upper bound, this eliminates bounds checks entirely.

CPython’s array/list access involves bounds checking too. If the uops optimizer could identify induction variables in typical for i in range(n) patterns and propagate that knowledge to subsequent list accesses, it could eliminate or weaken those checks. The trace recording frontend makes this more feasible because you have accurate execution data, not projections.

3. Guard Coalescing Matters

My redundant guard elimination pass removes ~30-50% of guards in typical traces. Guards are expensive not because the check itself is costly, but because each guard is a potential deoptimization point with state that must be maintained. Fewer guards means smaller deoptimization metadata, better code density, and fewer branch mispredictions.

CPython already does some guard elimination in the uops optimizer. But the new fitness/exit quality proposal on issue #146073 takes this further — it’s about trace selection, not just guard elimination.

4. Side Traces vs. Trace Stitching

When my JIT’s guard fails repeatedly, it records a side trace — a new path from the failure point back to the parent loop header. If successful, the side trace is inlined into the parent’s compiled code. This is expensive to implement (my side trace inliner checks that the side trace only touches promoted variables and uses simple operations) but eliminates the overhead of exiting and re-entering compiled code.

CPython’s approach of assembling stencils makes trace stitching more natural — you can extend a trace by appending more stencils. But the quality of trace endpoints matters enormously, which is exactly what the fitness/exit quality proposal addresses.

5. The “JIT Compiling a JIT” Problem

My JIT generates JavaScript and relies on V8 to JIT-compile it. This means I’m at the mercy of V8’s optimization heuristics — if V8 decides my generated code isn’t “hot enough,” it stays in the interpreter. I’ve seen cases where V8’s inline caches and type feedback interact badly with my generated code patterns.

CPython’s copy-and-patch approach sidesteps this entirely by producing machine code directly. But it also means CPython doesn’t get the benefit of a second optimization layer — V8’s register allocator and instruction scheduler sometimes improve my generated code beyond what my IR optimizations achieved. It’s a tradeoff, not a clear win either way.

Fitness and Exit Quality: Why Trace Boundaries Matter

The fitness/exit quality proposal on CPython’s tracker is, to me, one of the most important ongoing discussions about CPython’s JIT. Here’s the core idea:

Track two values during trace construction:

  • Fitness: starts high, decreases with branches (more for unpredictable branches), backward edges (a lot), and each instruction (a little, to cap trace length). Non-branch side exits start with lower fitness to reduce code duplication.

  • Exit quality: how “good” a given point is as a trace endpoint. High for the trace’s starting point, ENTER_EXECUTOR instructions (where another trace can pick up), and merge points in the control flow graph. Low for specializable instructions (you want to keep tracing past them).

Stop tracing when fitness drops below exit quality.

This is solving a problem I’ve encountered directly: trace length vs. trace quality is a tension. My JIT uses a simple max length (200 IR instructions) and records exactly one loop iteration. That works for Monkey’s simple loop patterns but would be terrible for Python’s complex control flow.

The fitness/exit quality model is more principled. It captures the intuition that:

  1. Long traces have diminishing returns. Each additional instruction in a trace adds some value (avoiding interpretation overhead) but also increases compilation cost, memory usage, and the chance of a guard failure that invalidates the whole thing.

  2. Not all endpoints are equal. Ending a trace at a merge point (where another trace can seamlessly continue) is much better than ending in the middle of a specialized instruction sequence. Ending at an ENTER_EXECUTOR means the next trace can pick up without an interpreter roundtrip.

  3. Branches destroy speculation. Every branch in a trace is a guard — a bet that execution will go the same way next time. Biased branches (99% one way) are cheap bets. Unbiased branches (50/50) are expensive ones. The fitness model penalizes branches proportionally to their unpredictability.

  4. Backward edges are expensive. A backward edge in a trace means you’re recording a nested loop. This massively increases trace complexity and guard state. My JIT handles this with trace stitching (executing an inner compiled trace as a single IR instruction), but the fitness model’s approach of heavily penalizing backward edges is cleaner.

For my Monkey JIT, I’d implement this as: start fitness at 100, subtract 5 per instruction, subtract 30 per branch, subtract 50 per backward edge. Exit quality = 100 at loop header, 80 at function entry, 20 elsewhere. Stop when fitness < exit quality. Simple, but I think it captures most of the value.

The Bigger Picture: Convergent Evolution

What strikes me is how the two approaches are converging. CPython started with copy-and-patch (fast compilation, limited optimization) and is now adding trace recording, type propagation, and guard elimination — moving toward the optimizations that tracing JITs do natively. My JIT started with tracing (aggressive optimization, slow compilation relative to copy-and-patch) and I’ve found myself wishing for faster compilation and better baseline code quality.

The mature JIT systems (V8, HotSpot, LuaJIT) use tiered compilation: a fast baseline JIT for quick startup, then an optimizing JIT for hot code. CPython’s architecture is actually well-positioned for this — copy-and-patch as the baseline tier, with a future optimizing tier that operates on the same uop IR but generates more aggressively optimized code.

My Monkey JIT is all-or-nothing: either you’re in the interpreter, or you’re running a fully-optimized trace. A baseline tier that just eliminates dispatch overhead — the way copy-and-patch does — would smooth out the “cold → hot” transition and reduce the number of iterations wasted before the JIT kicks in.

Conclusion

Building a tracing JIT from scratch gave me a visceral understanding of the tradeoffs that the CPython team navigates daily. My JIT can afford aggressive speculation because Monkey is a toy language with toy workloads. CPython serves millions of users running production code where a 2% regression is unacceptable and a 5% improvement is celebrated.

The copy-and-patch approach is, in my view, the right foundation for CPython. Fast compilation, minimal complexity, platform-agnostic runtime code. The optimization can come in layers — the uops optimizer gets smarter over time, the stencils get better with each LLVM release, and techniques like trace recording, guard elimination, and register allocation add up incrementally.

But the tracing JIT perspective offers something too: a reminder that the biggest wins come from eliminating work, not doing work faster. Store-to-load forwarding doesn’t make boxing faster — it removes boxing entirely. Range check elimination doesn’t make bounds checks faster — it proves they’re unnecessary. Guard coalescing doesn’t make guards cheaper — it removes the redundant ones.

The best JIT is one where the compiled code looks like what a human would write if they knew exactly what types everything would be. Both approaches are paths toward that goal.
